M.Sc. in Astrophysics will be better option to pursue. As you have already done Physics, so you will be eligible for it. Diploma will not be much helpful. Regular B.Sc. will have more benefits.

As the other mentor has answered, I would like to add that there are state level scholarships programme for degree students. For PG students, there is a provision for grants also. Check what scholarship scheme is run by government for UG students.

Admission is done on Merit Screening which means that the admissions is based on the marks obtained in graduation. Basic eligibility is the candidate must be a graduate from a recognized college /university.
